Best way to get around this is to enable the option in menu which says "Native Controller Input (Beta)"- this will deactivate controller support. After that, use Joy 2 Key.
It's not a great solution, but when developers are lazy and don't want to actually put proper controller support into the game, this is what happens.
I had no idea this was a thing. There's a few games I haven't been able to play - maybe now I can!
