Whenever I bind that action (typically to L5, I think), I make it a long press action so I wouldn't shut down a game by mistake even if I happen to slightly press the button by accident.
Of course I can't be sure if it will work in your situation or not but it would certainly be better than restarting the Deck.
So far, the only way out of this without restarting is to switch to Desktop mode and then switch back to game mode again.

To anyone else having this issue, the most graceful solution I was able to stumble across was to hold the power button, as if I was going to switch to desktop mode, and hit Cancel.
This brings me to the gaming mode Steam Home page, showing the most recently played game, which is still running in the background. When you select this, you’ll see the Resume button with an X button to the right of it. Hit that X, and it will close the game.
Not very expedient, but better than the alternatives, ig. Thanks everyone for your responses!
