Might've found a workaround from a related thread about Remote Play on the Steam Deck.
1. Plug in a controller to your main PC with a cable, I'm using a DS4.
2. Now start Remote Play on your other device.
This "tricks" steam into thinking you're using the controller that's plugged into your main PC. All haptics will go to your main PC controller, so might wanna put it on a pillow or something so it doesn't vibrate off your desk. It's janky, but better than nothing.
Plug in your controller via USB and play the game for a short while. Save and close.
Use Big Picture on Remote Play using the controller - this seems to 'remember' the settings from your desktop. And then I can use my Xbox controller on Remote Play.
At any point if I use my keyboard in the Steam interface or GoWR menu, it reverts back to the keyboard, the Xbox controller is dead in-game, and I have reload and redo all the steps again.
And for fun I reloaded GoW and it never has any issues.
